Most fault prediction models have class imbalance problems because training data usually contains much more non-fault class modules than fault class ones. This imbalanced distribution makes it difficult for the models to learn the minor class module data. Data imbalance is much higher when severity-based fault prediction is used. This is because high severity fault modules is a smaller subset of the fault modules. In this paper, we propose severity-based models to solve these problems using the three sampling methods, Resample, SpreadSubSample and SMOTE. Empirical results show that Resample method has typical over-fit problems, and SpreadSubSample method cannot enhance the prediction performance of the models. Unlike two methods, SMOTE method shows good performance in terms of AUC and FNR values. Especially J48 decision tree model using SMOTE outperforms other prediction models.
분류 문제는 주어진 입력 데이터에 대해 해당 데이터의 클래스를 예측하는 문제로, 자주 쓰이는 방법 중의 하나는 주어진 데이터셋을 사용하여 기계학습 알고리즘을 학습시키는 것이다. 이런 경우 분류하고자 하는 클래스에 따른 데이터의 분포가 균일한 데이터셋이 이상적이지만, 불균형한 분포를 가지고 경우 제대로 분류하지 못하는 문제가 발생한다. 이러한 문제를 해결하기 위해 본 논문에서는 Conditional Generative Adversarial Networks(CGAN)을 활용하여 데이터 수의 균형을 맞추는 오버샘플링 기법을 제안한다. CGAN은 Generative Adversarial Networks(GAN)에서 파생된 생성 모델로, 데이터의 특징을 학습하여 실제 데이터와 유사한 데이터를 생성할 수 있다. 따라서 CGAN이 데이터 수가 적은 클래스의 데이터를 학습하고 생성함으로써 불균형한 클래스 비율을 맞추어 줄 수 있으며, 그에 따라 분류 성능을 높일 수 있다. 실제 수집된 데이터를 이용한 실험을 통해 CGAN을 활용한 오버샘플링 기법이 효과가 있음을 보이고 기존 오버샘플링 기법들과 비교하여 기존 기법들보다 우수함을 입증하였다.
고객반응 예측모형은 마케팅 프로모션을 제공할 목표고객을 효과적으로 선정할 수 있도록 하여 프로모션의 효과를 극대화 할 수 있도록 해준다. 오늘날과 같은 빅데이터 환경에서는 데이터 마이닝 기법을 적용하여 고객반응 예측모형을 구축하고 있으며 본 연구에서는 사례기반추론 기반의 고객반응 예측모형을 제시하였다. 일반적으로 사례기반추론 기반의 예측모형은 타 인공지능기법에 비해 성과가 낮다고 알려져 있으나 입력변수의 중요도에 따라 가중치를 상이하게 적용함으로써 예측성과를 향상시킬 수 있다. 본 연구에서는 프로모션에 대한 고객의 반응여부에 영향을 미치는 중요도에 따라 입력변수의 가중치를 산출하여 적용하였으며 동일한 가중치를 적용한 예측모형과의 성과를 비교하였다. 목욕세제 판매데이터를 사용하여 고객반응 예측모형을 개발하고 로짓모형의 계수를 적용하여 입력변수의 중요도에 따라 가중치를 산출하였다. 실증분석 결과 각 변수의 중요도에 기반하여 가중치를 적용한 예측모형이 동일한 가중치를 적용한 예측모형보다 높은 예측성과를 보여주었다. 또한 고객 반응예측 모형과 같이 실생활의 분류문제에서는 두 범주에 속하는 데이터의 수가 현격한 차이를 보이는 불균형 데이터가 대부분이다. 이러한 데이터의 불균형 문제는 기계학습 알고리즘의 성능을 저하시키는 요인으로 작용하며 본 연구에서 제안한 Weighted CBR이 불균형 환경에서도 안정적으로 적용할 수 있는지 검증하였다. 전체데이터에서 100개의 데이터를 무작위로 추출한 불균형 환경에서 100번 반복하여 예측성과를 비교해 본 결과 본 연구에서 제안한 Weighted CBR은 불균형 환경에서도 일관된 우수한 성과를 보여주었다.
이분형 자료의 분류에서 자료의 불균형 정도가 심한 경우 분류 결과가 좋지 않을 수 있다. 이런 문제 해결을 위해 학습 자료를 변형시키는 등의 연구가 활발히 진행되고 있다. 본 연구에서는 이러한 이분형 자료의 분류문제에서 불균형을 다루기 위한 방법들 중 표본재추출 방법들을 비교하였다. 이를 통해 자료에서 희소계급의 탐지를 보다 효과적으로 하는 방법을 찾고자 하였다. 모의실험을 통하여 여러 오버샘플링, 언더샘플링, 오버샘플링과 언더샘플링 혼합방법의 총 20가지를 비교하였다. 분류문제에서 대표적으로 쓰이는 로지스틱 회귀분석, support vector machine, 랜덤포레스트 모형을 분류기로 사용하였다. 모의실험 결과, 정확도가 0.5 이상이면서 민감도가 높았던 표본재추출 방법은 random under sampling (RUS)였다. 그 다음으로 민감도가 높았던 방법은 오버샘플링 ADASYN (adaptive synthetic sampling approach)이었다. 이를 통해 RUS 방법이 희소계급값을 찾기 위한 방안으로는 적합했다는 것을 알 수 있었다. 몇 가지 실제 자료에 적용한 결과도 모의실험의 결과와 비슷한 양상을 보였다.

In recent research, deep learning-based methods have achieved state-of-the-art performance in various computer vision tasks. However, these methods are commonly supervised, and require huge amounts of annotated data to train. Acquisition of data demands an additional costly effort, particularly for the tasks where it becomes challenging to obtain large amounts of data considering the time constraints and the requirement of professional human diligence. In this paper, we present a data level synthetic sampling solution to learn from small and imbalanced data sets using Generative Adversarial Networks (GANs). The reason for using GANs are the challenges posed in various fields to manage with the small datasets and fluctuating amounts of samples per class. As a result, we present an approach that can improve learning with respect to data distributions, reducing the partiality introduced by class imbalance and hence shifting the classification decision boundary towards more accurate results. Our novel method is demonstrated on a small dataset of 2789 tomato plant disease images, highly corrupted with class imbalance in 9 disease categories. Moreover, we evaluate our results in terms of different metrics and compare the quality of these results for distinct classes.
Timely and accurate diagnosis of lung diseases using Chest X-ray images has been gained much attention from the computer vision and medical imaging communities. Although previous studies have presented the capability of deep convolutional neural networks by achieving competitive binary classification results, their models were seemingly unreliable to effectively distinguish multiple disease groups using a large number of x-ray images. In this paper, we aim to build an advanced approach, so-called Ensemble Knowledge Distillation (EKD), to significantly boost the classification accuracies, compared to traditional KD methods by distilling knowledge from a cumbersome teacher model into an ensemble of lightweight student models with parallel branches trained with ground truth labels. Therefore, learning features at different branches of the student models could enable the network to learn diverse patterns and improve the qualify of final predictions through an ensemble learning solution. Although we observed that experiments on the well-established ChestX-ray14 dataset showed the classification improvements of traditional KD compared to the base transfer learning approach, the EKD performance would be expected to potentially enhance classification accuracy and model generalization, especially in situations of the imbalanced dataset and the interdependency of 14 weakly annotated thorax diseases.
전 세계적으로 사이버 공격은 계속 증가해 왔으며 그 피해는 정부 시설을 넘어 민간인들에게 영향을 미치고 있다. 이러한 문제로 사이버 이상징후를 조기에 식별하여 탐지할 수 있는 시스템 개발의 중요성이 강조되었다. 위와 같이, 사이버 이상징후를 효과적으로 식별하기 위해 BGP(Border Gateway Protocol) 데이터를 머신러닝 모델을 통해 학습하고, 이를 이상징후로 식별하는 여러 연구가 진행되었다. 그러나 BGP 데이터는 이상 데이터가 정상 데이터보다 적은 불균형 데이터(Imbalanced data)이다. 이는, 모델에 학습이 편향된 결과를 가지게 되어 결과에 대한 신뢰성을 감소시킨다. 또한, 실제 사이버 상황에서 보안 담당자들이 머신러닝의 정형적인 결과로 사이버 상황을 인식시킬 수 없는 한계도 존재한다. 따라서 본 논문에서는 전 세계 네트워크 기록을 보관하는 BGP(Border Gateway Protocol)를 조사하고, SMOTE(Synthetic Minority Over-sampling Technique) 활용해 불균형 데이터 문제를 해결한다. 그 후, 사이버 공방(Cyber Range) 상황을 가정하여, 오토인코더를 통해 사이버 이상징후 분류하고 분류된 데이터를 가시화한다. 머신러닝 모델인 오토인코더는 정상 데이터의 패턴을 학습시켜 이상 데이터를 분류하는 성능을 92.4%의 정확도를 도출했고 보조 지표도 90%의 성능을 보여 결과에 대한 신뢰성을 확보한다. 또한, 혼잡한 사이버 공간을 가시화하여 효율적으로 상황을 인식할 수 있기에 사이버 공격에 효과적으로 방어할 수 있다고 전망된다.
